Exploding Gradient Problem
What Is the Exploding Gradient Problem?
The exploding gradient problem is a neural-network training failure in which error signals become extremely large during backpropagation. Huge gradients cause unstable weight updates, making loss spike or become infinity or NaN, meaning “not a number.”
A gradient tells the system how to change model settings to reduce error. Backpropagation sends this signal through the network; if it grows too large, one update can push the model away from a useful solution.
Why Do Gradients Explode?
Exploding gradients result from repeated multiplication during training, especially across many layers or time steps.
- The model makes a prediction and calculates error.
- Backpropagation sends error information toward earlier layers.
- Each layer multiplies local derivatives and weight effects.
- If enough factors exceed one, the product grows rapidly.
- The optimizer applies a huge update and destabilizes parameters.
Deep and recurrent neural networks are vulnerable because they repeat this process often. Large initial weights, an unsuitable learning rate, and poorly scaled inputs can increase amplification.
Exploding vs. Vanishing Gradients
Both disrupt learning, but in opposite directions.
| Aspect | Exploding gradients | Vanishing gradients |
|---|---|---|
| Gradient size | Becomes extremely large | Shrinks toward zero |
| Training behavior | Loss spikes, NaN values, erratic updates | Loss changes slowly or stalls |
| Learning effect | Parameters overshoot useful values | Earlier layers learn very little |
| Typical remedies | Clipping, lower learning rate, better initialization | Residual or gated designs, suitable activations |
How to Detect Exploding Gradients
Monitor training rather than waiting for failure.
- Track loss and gradient norms for each step or batch.
- Watch for NaN or infinity in loss, gradients, or outputs.
- Inspect sudden jumps in parameters or validation loss.
- Use a fixed random seed to investigate repeatable failures.
- Check whether a single corrupted batch caused the spike.
How to Fix an Exploding Gradient
Start with simple fixes, then review the model and data pipeline.
- Use gradient clipping by norm or value.
- Lower the learning rate.
- Use initialization suited to the activation functions and layer shapes.
- Normalize inputs and check labels, loss calculations, and preprocessing for invalid values.
- Consider residual connections or gated recurrent architectures for deep or sequential models.
Gradient clipping protects an update, but it does not fix faulty data, an incorrect loss function, or an unsuitable architecture.
Exploding Gradients in AI Application Development
For custom model training, treat stability as an engineering requirement. Check for finite loss values, log gradient norms, and stop or roll back failed runs before a bad model reaches users. Sound app design and development includes testing data and monitoring paths around an AI feature, not only its interface.
