Embedding Quantization
What Is Embedding Quantization?
Embedding quantization compresses AI embedding vectors by converting high-precision numbers into smaller, lower-precision forms. It reduces memory and compute for semantic search and retrieval, with some risk to match accuracy. An embedding is a numeric representation of meaning for a document, product, or question. Quantization makes vectors cheaper to store and compare in vector databases for similarity search and retrieval-augmented generation, or RAG.
How Embedding Quantization Works
The goal is to retain useful semantic signal while using fewer bits per vector value.
- Create full-precision embeddings, often using float32 values.
- Calibrate value ranges or learn codebooks from sample vectors.
- Encode vectors as lower-precision integers, bits, or compact codes.
- Search the quantized index for likely matches.
- Optionally rescore top candidates with original float vectors.
Types of Embedding Quantization
Vector quantization replaces continuous values with a limited set of representations. The best approach depends on collection size and acceptable recall loss.
| Method | Representation and search | Best fit |
|---|---|---|
| Scalar INT8 | Maps each value to an 8-bit integer. It can reduce float32 storage by about four times while retaining useful detail. | A strong starting point for quality-sensitive search. |
| Binary 1-bit | Stores each dimension as a bit and compares bit patterns efficiently. It can reduce float32 storage by about 32 times. | High-volume candidate retrieval with rescoring. |
| Product quantization | Splits vectors into parts and represents each with a learned codebook entry. | Very large collections where memory is the main constraint. |
Benefits of Quantized Embeddings
Quantization is useful when vector data becomes a meaningful infrastructure cost.
- Reduces vector index storage and memory pressure.
- Improves cache efficiency and can reduce retrieval latency.
- Speeds early-stage candidate search in many vector engines.
- Helps semantic search and RAG systems work within tighter compute budgets.
Limitations and Accuracy Risks
Compression discards detail, so it should be evaluated rather than used by default.
- Similar items may change rank or drop from top results.
- Quality varies by embedding model, language, domain, and query style.
- Outdated calibration data can weaken results as content changes.
- A retrieval miss can give a downstream RAG model incomplete evidence.
Choosing a Method and Validating Search Quality
Test with representative queries and relevance judgments from the real application.
- Start with INT8 when preserving search quality is the priority.
- Use binary vectors for broad retrieval, then rescore with float vectors.
- Consider product quantization for extremely large collections.
- Measure recall at K, latency, memory use, and answer quality together.
