Product Quantization
What Is Product Quantization?
Product quantization is a vector compression technique that splits an embedding into smaller parts and replaces each part with a compact codebook index. It reduces memory and compute for approximate nearest-neighbor search while accepting some loss of accuracy.
Quantization maps many numeric values to fewer representative values. Applied to embeddings, which are number lists AI systems use to compare text, images, or products, it is lossy compression because it stores an approximation rather than every original value.
How Product Quantization Works
PQ compresses each vector in these stages.
- Split an embedding into smaller sub-vectors.
- Train representative centroid codebooks for each sub-vector position.
- Replace each sub-vector with the ID of its nearest centroid.
- Store the compact IDs as a PQ code.
- Compare an uncompressed query with centroid lookup tables at search time, using asymmetric distance computation.
For example, a system can split a document embedding into four parts and store four centroid IDs instead of all original numbers.
Product Quantization vs. Other Vector Compression Methods
Quantization is one type of compression. The best method depends on the memory budget and acceptable recall level.
| Method | Storage approach | Accuracy and use |
|---|---|---|
| Full precision | Stores original floating-point values | Highest fidelity, suitable for smaller collections or reranking |
| Scalar quantization | Compresses each value independently | Simple option with moderate quality tradeoffs |
| Binary quantization | Represents values with bits | Very compact, but can lose more detail |
| Product quantization | Stores a centroid ID for each sub-vector | Efficient approximate search for large embedding collections |
Benefits of Product Quantization
PQ is useful when a vector index outgrows available memory.
- Reduces vector-index memory requirements.
- Speeds approximate distance scoring through lookup tables.
- Supports larger semantic search, recommendation, image retrieval, and retrieval-augmented generation systems.
- Can reduce infrastructure pressure without changing the embedding model.
Practical Limits of Product Quantization
Centroid IDs are approximations, so product quantization reduces accuracy to some degree.
- Quantization error can lower recall, meaning relevant results may be missed.
- Codebooks must represent production data, or quality can decline.
- Training codebooks and rebuilding an index take time after major data or model changes.
- Many systems rerank top results against original vectors to improve relevance.
How to Choose Product Quantization Settings
More code capacity usually improves recall but uses more memory.
- Start with representative queries and known relevant results.
- Test subspace counts and codebook sizes against recall and latency targets.
- Keep original vectors when high-quality reranking matters.
- Re-evaluate settings after changing the embedding model or data distribution.
Product Quantization in AI Application Development
Teams should test retrieval quality alongside application behavior. Product quantization can help semantic search scale, but users still need accurate answers and relevant results. Resources on app design and development and building a SaaS product without coding can help define requirements. Emergent lets teams describe, build, test, and deploy full-stack AI applications, including products that need scalable vector search.
