Top-K Sampling

Top-K sampling is a language model decoding method that limits each next-token choice to a fixed number of the most likely options. It filters out lower-probability tokens, then randomly selects from the remaining set. The setting balances output consistency and variety, but its fixed cutoff does not adapt to the model's confidence.

What Is Top-K Sampling in LLMs?

Top-K sampling is a language model decoding method that limits each next-token choice to K of the most likely options. It removes lower-probability tokens and randomly selects from the rest. A token can be a word, part of a word, or punctuation.

How Top-K Sampling Works

The model repeats these steps until it reaches a stopping rule.

  1. It assigns a probability to every possible next token.
  2. It ranks tokens from most to least likely.
  3. It keeps the top K candidates and excludes the rest.
  4. It rescales retained probabilities to total 100 percent.
  5. It randomly selects one token and repeats the process.

If four tokens have probabilities of 45, 30, 15, and 10 percent and K is 3, the 10 percent option is removed. The others are rescaled and sampled from. Choosing the 45 percent option every time is greedy decoding.

Top-K vs. Top-P Sampling vs. Temperature

These controls affect generation differently and can be combined in some model APIs.

ControlWhat it changesCandidate set
Top-KKeeps the highest-ranked tokensFixed number
Top-PKeeps tokens until their combined probability reaches PChanges with model confidence
TemperatureSharpens or flattens probability differencesDoes not set a cutoff alone

Temperature can be used with top-K. Top-P, also called nucleus sampling, is more adaptive because its candidate count changes with context.

Benefits of Top-K Sampling

Top-K sets a clear boundary for controlled text generation.

  • It suppresses extremely unlikely tokens that can push output off topic.
  • It provides more variety than greedy decoding when several choices are plausible.
  • Its fixed candidate-set size makes experiments easier to compare.
  • K is an understandable parameter for evaluating model behavior.

Limits of a Fixed K Value

A fixed cutoff does not reflect confidence in a specific context.

  • A high K can retain weak choices when only a few tokens are likely.
  • A low K can remove useful alternatives when many candidates are plausible.
  • Very low settings can increase repetition and predictable wording.
  • Sampling settings cannot guarantee factual accuracy, secure tool calls, or safe output. Applications still need validation and guardrails.

How to Choose a Top-K Setting

There is no universally correct value. Test K for the real task.

  • Start with the model provider's default setting when available.
  • Define quality criteria, such as valid JSON, passing code tests, or tone variety.
  • Test representative prompts repeatedly because sampling can produce different outputs.
  • Change one control at a time, such as K before temperature.
  • Log the model version, prompt, K, temperature, and evaluation result for reproducible comparisons.

Top-K Sampling in AI App Development

In production AI features, top-K is part of a broader reliability strategy including prompt design, output validation, evaluations, and user controls. Builders can test settings in app design and development and document behavior with other AI terms in the Emergent glossary.
